Windows 11 Wallpaper changes from Slideshow to a Picture right when I switch desktops

Every time I switch to another desktop, I see my background change to a still picture. I have tried switching the desktops using a key combination - WIN + Ctrl + Left/Right arrow key and also by clicking on the desktops icon on the taskbar and selecting another desktop. The issue happens with either.
